Have you tried neatsfoot oil? Should be available locally at a saddle/tack shop. Bear in mind that the colour of leather is a sort of paint and dye, so any treatment has to get through this to get to the leather. When this coating starts to crack up and the finish starts to age a bit, treatment potions can get into the leather itself and help to make it more supple. I'm not going to suggest that you take the leather covers off and apply the treatment from the back but it might well work.
